Anatomy of a Token: The Complete LLM Forward Pass in C
That is the LLM forward pass. I implemented every step in C for EdgeLM, our lightweight inference engine built to run transformer models without a GPU.

That is the LLM forward pass. I implemented every step in C for EdgeLM, our lightweight inference engine built to run transformer models without a GPU. What I found was not magic: matrix multiplications, a softmax, and some normalization that an engineer from the 1980s would recognize.
But the details matter enormously. The gap between a naive implementation and a memory-aware one is a 4x throughput difference on identical hardware. Understanding why that gap exists requires knowing what each operation does, in code, not diagrams.
This post walks through the complete LLM forward pass in C using a Llama-style architecture (the dominant open-source design as of 2025). You will see actual working C for each step, understand what is compute-bound versus memory-bound, and leave with a mental model you can apply to any inference optimization problem.
I am not using llama.cpp as a reference. That codebase has 200K lines, CUDA paths, and AVX intrinsics woven throughout. We start from first principles: clean, readable C that compiles with gcc -O2 and produces correct output.
The Journey of a Token: Full Pipeline at a Glance
A token is an integer: an index into a vocabulary. "Hello" might be token 9906 in Llama's tokenizer. The entire LLM forward pass converts that integer into 128,256 floating-point numbers (one per vocabulary token), representing the probability distribution for what comes next.
Here is the complete pipeline, using Llama 3.2 1B as a concrete reference (dim=2048, n_heads=32, n_kv_heads=8, n_layers=16, vocab_size=128,256):

Steps 2–11 repeat for every layer (16 layers in the 1B model, 32 in the 7B). After all layers, a final RMSNorm and the language model head project the residual to vocab_size logits.
That is it. No magic. A carefully designed sequence of linear transformations and normalizations. Why this architecture converges so well is an open research question. Why each piece is necessary is something we can explain.
Memory Layout: How Weights Live in RAM
Before writing a single operation, we need a model for how weights are stored. Every operation in the forward pass is bottlenecked not by compute but by how fast we can load weights from RAM, a fact that shapes every optimization decision.
The weights for Llama 3.2 1B in float32 occupy 4.4 GB. At float16, that is 2.2 GB. On a modern consumer CPU with 50 GB/s memory bandwidth, loading all weights once takes roughly 44ms at float32. Quantize to int8 and that drops to 11ms, before you have written a single optimized kernel.
This is why quantization matters more than kernel-level optimization for CPU inference. Moving from float32 to int8 cuts the bandwidth tax by 4x. The forward pass structure is unchanged: only the weight loading and matmul change.
In C, we represent the model as a flat struct of float pointers:

For autoregressive generation, every call reads all weight matrices but processes a single activation vector: one new token per forward pass. This is the maximally memory-bandwidth-bound regime. The roofline model says you spend about 99% of time waiting for data, not computing.
We will return to that analysis at the end. First, let us trace the token.
Step 1: Token Embedding: From Integer to Float Vector
The embedding table is a matrix of shape [vocab_size × dim]. Each row is the learned floating-point representation of one token. Token embedding is a table lookup, nothing more.

Use mmap() to load the weight file and let the OS page in the embedding table lazily. For interactive inference serving varied prompts, this avoids loading the full 1 GB table at startup and lets the OS manage which rows stay hot in page cache.
Why no positional information here? Earlier transformer designs (GPT-2, original BERT) added a learned positional embedding at this step. Modern Llama-style models push position information inside the attention layer using RoPE instead. The embedding table is semantic only. Position comes in Step 4.
Step 2: RMSNorm: Taming the Distribution
RMSNorm (Root Mean Square Layer Normalization) stabilizes activations before attention and before the feed-forward network. Without normalization, residual accumulation across 32 layers causes activations to explode or vanish, making training collapse.
RMSNorm vs. LayerNorm: LayerNorm subtracts the mean and divides by standard deviation. RMSNorm skips mean subtraction and only normalizes by the RMS of the activations. According to Zhang and Sennrich (2019), this achieves equivalent training stability while being about 10% faster to compute, since the mean computation and its backward pass are eliminated.
The math: given input x, compute RMS(x) = sqrt(mean(x²) + ε), then output = (x / RMS(x)) × weight.

}Two passes over the input vector: one for the sum of squares, one for scaling. Both are trivially vectorizable. GCC with -O2 -march=native auto-vectorizes these loops into AVX2 instructions on modern x86 hardware.
The weight parameter is a learned per-element scale, initialized to ones during training. RMSNorm has no bias term, which means one fewer parameter to load per normalization call.
Why this matters in practice: RMSNorm is called twice per transformer layer (pre-attention and pre-FFN) plus once at the end. For a 32-layer model, that is 65 RMSNorm calls per token. At dim=4096, each call reads 4096 floats twice, roughly 2 MB of memory bandwidth per forward pass for normalization alone. This is why fast memory access, not floating-point throughput, determines inference speed.
Step 3: QKV Projections: Setting Up Attention
Attention requires three derived vectors from the normalized token representation: Query (Q), Key (K), and Value (V). Each comes from multiplying the activation by a learned weight matrix.
In Llama 3.2 1B with Grouped Query Attention (GQA), Q has shape [dim=2048], while K and V have shape [kv_dim=512]: four query heads per KV head pair, reducing KV cache size by 4x versus standard multi-head attention.

Instead of n_heads KV pairs (32 for 7B), you have n_kv_heads pairs (8 for 7B). Multiple query heads share the same key and value. This cuts KV cache memory by 4x and reduces the memory bandwidth for KV reads during attention.
The matmul above is the dominant operation across the entire forward pass. For Llama 3.2 7B, wq alone is 4096×4096 = 64 MB per layer at float32. Loading all three QKV weight matrices across 32 layers costs 6 GB of memory bandwidth per token. This is why quantization is not optional for practical CPU inference.
Here is the arithmetic: at 50 GB/s peak bandwidth and 6 GB of QKV weight reads, you spend 120ms on QKV loading per token at float32. At int8, that drops to 30ms. The difference between 8 tok/s and 33 tok/s is in weight dtype.
Step 4: Rotary Position Embeddings (RoPE) in C
RoPE encodes token position by rotating Q and K vectors in 2D subspaces. Unlike absolute positional embeddings added once at the input, RoPE applies inside every attention layer, making position part of the attention score computation itself.
Why RoPE works: After applying RoPE rotations, the dot product of a query at position m and a key at position n depends on their content and their relative position (m − n). The model learns position-relative attention patterns rather than absolute ones. This is why LLMs with RoPE generalize more gracefully to contexts longer than their training window than models with learned absolute embeddings.
Su et al. (2021) introduced RoPE in the RoFormer paper. It has since been adopted in Llama, Mistral, Qwen, Gemma, and virtually every major open-source LLM as of 2025.
The rotation for each dimension pair (2i, 2i+1) at position pos uses frequency:

}Precompute the (cos_t, sin_t) table for all positions and frequencies at model load time. For a 4096-token context and head_dim=128, that is 4096 × 64 = 262K float pairs, negligible memory. The hot path becomes pure multiplications and additions, eliminating all powf/cosf/sinf calls during inference.
In EdgeLM, we store float rope_cos[MAX_SEQ_LEN][head_dim/2] and rope_sin[MAX_SEQ_LEN][head_dim/2] computed once at init. This alone recovers about 8% of single-token latency compared to computing sin/cos inline, since transcendental functions are expensive (about 20 cycles each on modern x86).
Step 5: Scaled DotProduct Attention: The Core Mechanism
Attention lets every token look at every previous token and decide how much weight to give each one. The formula:
Attention(Q, K, V) = softmax(QK^T / sqrt(head_dim)) * VIn autoregressive generation, we compute attention for only the new token against all previous positions. K and V from prior tokens are cached. The KV cache is the most memory-intensive data structure in an inference engine.

For a 4096-token context with head_dim=128, that is about 1.6M multiply-adds per head. Across 32 heads and 32 layers, attention totals roughly 1.6B operations, comparable to the entire FFN.

For Llama 3 7B: heads_per_kv = 32 / 8 = 4, meaning query heads 0-3 share KV head 0, heads 4-7 share KV head 1, and so on. This is the mathematical heart of GQA: simple integer division maps each query to its KV head.
Step 6: FeedForward Network and SwiGLU
After attention updates the token's representation based on context, the feed-forward network transforms it independently. Each token is processed separately, with no cross-token interaction. Every FFN layer is a learned nonlinear function applied to the residual stream.
Llama uses SwiGLU activation, introduced by Noam Shazeer (2020). Standard transformers use a two-layer MLP: FFN(x) = W2 × GELU(W1 × x). SwiGLU splits the first projection into two parallel paths and gates them element-wise:

}Why SwiGLU beats GELU: Shazeer's 2020 paper showed SwiGLU variants consistently lower language modeling perplexity by 0.3–0.5 nats versus GELU and ReLU across model sizes from 125M to 13B parameters. The empirical gap is small per token but compounds across pretraining, enough to matter at the scale of Llama's training budget.
But there is a catch: SwiGLU requires three weight matrices instead of two. To keep total parameter count equivalent to a standard two-matrix FFN, Llama reduces hidden_dim to about 8/3 × dim (rounded to a multiple of 256 for hardware alignment). For dim=4096, this gives hidden_dim=11008 in Llama 2, increased to 14336 in Llama 3.
FFN dominates the parameter count. For a 7B Llama model, the three FFN matrices per layer contribute about 60% of total parameters. The 32 wgate matrices alone total 32 × 14336 × 4096 floats = 7.5 GB at float32. If you quantize aggressively, quantize FFN weights first; the return per byte saved is highest there.
The residual add after FFN is two lines:

}The residual stream carries the "identity" signal through all layers. Attention and FFN add refinements to it, not replacements. This is what allows training to scale to 32 layers without gradient vanishing. The gradient can flow directly through the residual path, bypassing every layer if needed.
Step 7: The Final Projection From Residual to Logits
After all N layers, the residual stream holds a contextual representation of the sequence up to and including the current token. Two operations convert it to a probability distribution over the vocabulary.
Final RMSNorm: Identical to the per-layer norms. Normalize the output of the last transformer layer before the vocabulary projection.
Language Model Head (lm_head): A linear projection from [dim] to [vocab_size]. The result is raw logits: one score per vocabulary token.

It also reads 128,256 × 4096 × 4 bytes = 2 GB of weight data. Skip softmax for greedy decoding; the argmax does not require normalized probabilities.

Andrej Karpathy's llama2.c was the first public single-file C implementation in this style, and it remains the cleanest reference. EdgeLM builds on the same structure, adding int8 quantization, a production KV cache with LRU eviction for long sessions, and AVX2 matmul kernels. The architectural skeleton is unchanged.
Each call to forward() produces one token's worth of logits. Generation is a loop:

Where Bottlenecks Hide: A Roofline Analysis
Now that every operation is visible, we can reason about where time goes. The roofline model characterizes operations by arithmetic intensity: floating-point operations per byte of memory loaded.
The fundamental problem with single-token inference: Every matmul reads its entire weight matrix to multiply against one activation vector. For a matrix W of shape [out_dim, in_dim]:
